چکیده
مقدمه و اهداف: در عصر کنونی که رقابت جهانی، پایداری و دیجیتالی‌شدن به ارکان اصلی موفقیت صنایع تبدیل شده‌اند، ارزیابی عملکرد واحدهای تولیدی اهمیتی دوچندان یافته است. در این شرایط، سازمان‌ها ناگزیرند میان الزامات چابکی در پاسخ‌گویی سریع به تغییرات بازار، ضرورت رعایت اصول پایداری در ابعاد اقتصادی، اجتماعی و زیست‌محیطی، و بهره‌گیری از فناوری‌های نوین صنعت 4.0 تعادل برقرار کنند. با این حال، اغلب مدل‌های ارزیابی عملکرد موجود تنها بر یکی از این ابعاد متمرکز بوده و توانایی تلفیق هم‌زمان آن‌ها را ندارند. بر همین اساس، هدف اصلی پژوهش حاضر توسعه یک مدل داده‌محور و ترکیبی مبتنی بر تحلیل پوششی داده‌ها و الگوریتم یادگیری ماشین جنگل تصادفی است که بتواند عملکرد واحدهای تولیدی را با در نظر گرفتن ابعاد چابکی، پایداری و دیجیتالی‌شدن، به صورت مستقل و بدون نیاز به مقایسه مستقیم با سایر واحدها ارزیابی کند.
روش‌ها: در گام نخست، مجموعه‌ای از شاخص‌های ارزیابی عملکرد در چهار دسته‌ی اصلی شامل چابکی، پایداری، دیجیتالی‌شدن و شاخص‌های عمومی از طریق مرور ادبیات و نظرات خبرگان شناسایی گردید. سپس برای تعیین اهمیت نسبی شاخص‌ها، از روش بهترین–بدترین فازی استفاده شد که امکان مقایسه‌ی دقیق و سازگار میان شاخص‌ها را فراهم می‌سازد. پس از تعیین وزن‌ها، هشت شاخص کلیدی با بالاترین اهمیت به‌عنوان ورودی و خروجی مدل تحلیل پوششی داده‌ها انتخاب شدند تا نمرات کارایی هر واحد تولیدی محاسبه شود. داده‌های پژوهش از اطلاعات ۴۰ شرکت بورسی و در بازه زمانی پنج‌ساله جمع‌آوری گردید که منجر به تشکیل ۴۰۰ رکورد داده‌ای شد. برچسب‌های کارایی به‌دست‌آمده از مدل اندرسون–پیترسون به‌عنوان داده‌ی آموزشی در الگوریتم جنگل تصادفی استفاده شدند تا مدل نهایی پیش‌بینی و ارزیابی عملکرد توسعه یابد. برای ارزیابی دقت مدل، داده‌ها به دو بخش آموزش (۷۰٪) و آزمون (۳۰٪) تقسیم شدند و شاخص‌های دقت، دقت مثبت، بازیابی و امتیاز F1 محاسبه گردید.
یافته‌ها: نتایج حاصل از روش بهترین-بدترین فازی نشان داد که بُعد چابکی بیشترین اهمیت را در ارزیابی عملکرد دارد و شاخص‌های سرعت، کیفیت، انعطاف‌پذیری و ظرفیت تولید از میان مهم‌ترین مؤلفه‌ها شناخته شدند. پس از آن، ابعاد پایداری و دیجیتالی‌شدن در رتبه‌های بعدی اهمیت قرار گرفتند که شاخص‌هایی همچون زیرساخت مالی، گواهی‌نامه‌های زیست‌محیطی، هوشمند بودن فرآیندها و استفاده از فناوری‌های داده‌محور، نقش بسزایی در عملکرد داشتند. مدل تحلیل پوششی داده‌ها توانست سطوح کارایی واحدهای تولیدی را در چهار طبقه ناکارا، کارای ضعیف، کارا و کارای قوی طبقه‌بندی نماید. سپس مدل یادگیری ماشین توسعه‌یافته بر پایه الگوریتم جنگل تصادفی، توانست با دقتی معادل 925/0 و امتیاز F1 برابر با 911/0 عملکرد واحدهای تولیدی را به‌درستی پیش‌بینی کند که بیانگر قدرت بالای مدل در یادگیری الگوهای رفتاری و ساختارهای درونی داده‌ها است. همچنین نتایج ماتریس درهم‌ریختگی نشان داد که بیشتر خطاهای پیش‌بینی مربوط به جابجایی میان کلاس‌های مجاور است، که نشان از پایداری مدل در تمایزگذاری سطوح عملکردی دارد. بررسی ضرایب اهمیت ویژگی‌ها در مدل یادگیری ماشین نیز تأیید کرد که شاخص‌های چابکی، بیشترین تأثیر را در پیش‌بینی سطح کارایی دارند و به‌ویژه، شاخص سرعت در تصمیم‌گیری و انعطاف‌پذیری تولید بیشترین اثر را در بهبود بهره‌وری واحدهای تولیدی دارد.
نتیجه‌گیری: پژوهش حاضر نشان داد که به‌کارگیری رویکردهای داده‌محور و ترکیبی می‌تواند محدودیت‌های مدل‌های سنتی ارزیابی عملکرد را رفع نموده و دقت، تفسیرپذیری و کارایی تحلیل را به شکل چشمگیری افزایش دهد. مدل توسعه‌یافته این قابلیت را دارد که هر واحد تولیدی را به‌صورت مستقل ارزیابی نماید و ضمن ترکیب سه بُعد کلیدی چابکی، پایداری و صنعت 4.0، تصویری جامع از وضعیت عملکردی سازمان ارائه دهد. این رویکرد می‌تواند به‌عنوان ابزاری کارآمد برای مدیران در تصمیم‌گیری‌های راهبردی، بهبود بهره‌وری، برنامه‌ریزی تولید و ارزیابی اثرات سیاست‌های صنعتی مورد استفاده قرار گیرد. بر اساس نتایج، توصیه می‌شود در پژوهش‌های آتی از روش‌های یادگیری ماشین پیشرفته‌تر و داده‌های پویا جهت تحلیل روندهای زمانی عملکرد واحدهای تولیدی بهره‌گیری شود تا توان تبیینی مدل افزایش یابد.

Introduction: In today’s competitive industrial environment, performance evaluation of manufacturing units has become a critical factor for improving productivity, quality, and competitiveness. Organizations must simultaneously address three major challenges — agility in responding to rapid market changes, sustainability across economic, social, and environmental dimensions, and digital transformation driven by Industry 4.0 technologies. However, most of the existing performance evaluation frameworks focus on a single dimension and lack the ability to integrate these three aspects concurrently. Accordingly, this study aims to develop a data-driven hybrid model based on Data Envelopment Analysis (DEA) and the Random Forest (RF) algorithm to evaluate the performance of manufacturing units considering agility, sustainability, and digitalization dimensions. The proposed framework enables independent evaluation of each manufacturing unit without the need for direct comparison with others.
Methods: In the first stage, a comprehensive set of performance evaluation indicators was identified through literature review and expert consultation, categorized into four groups: agility, sustainability, digitalization, and general indicators. To determine the relative importance of these indicators, the Fuzzy Best–Worst Method (FBWM) was employed, allowing consistent pairwise comparisons among the selected indicators. After calculating the weights, eight key indicators with the highest importance were selected as the input and output variables for the DEA model to compute efficiency scores. Data were collected from 40 listed manufacturing firms over a five-year period, resulting in 400 data records. The efficiency scores obtained from the Andersen–Peterson (AP-DEA) model were then used as labeled data for training the Random Forest model. Seventy percent of the dataset was used for training and the remaining 30 percent for testing. The model’s predictive accuracy was evaluated using four standard metrics: Accuracy, Precision, Recall, and F1 Score.
Results and Discussion: The FBWM results revealed that agility is the most influential dimension in performance evaluation, followed by sustainability and digitalization. Within the agility dimension, speed, quality, flexibility, and production capacity emerged as the most critical indicators. In the sustainability dimension, financial infrastructure, environmental certification, and waste management showed a significant impact, while in the digitalization dimension, smart operations and data-driven planning were identified as key contributors. The DEA model successfully classified manufacturing units into four performance levels — inefficient, weakly efficient, efficient, and highly efficient — enabling a structured labeling process for subsequent machine learning analysis. The developed Random Forest model achieved an accuracy of 0.925 and an F1 Score of 0.911, outperforming comparative models such as Support Vector Machine (SVM) and Artificial Neural Network (ANN). The confusion matrix results confirmed that most prediction errors occurred between adjacent classes, demonstrating the model’s robustness and reliability. Furthermore, the feature importance analysis indicated that agility-related variables, particularly speed and flexibility, had the highest influence on performance prediction. These findings highlight the superiority of data-driven hybrid models in extracting meaningful patterns and enhancing interpretability in complex decision environments.
Conclusions: The study demonstrated that adopting a data-driven hybrid approach can overcome the limitations of traditional performance evaluation models and substantially improve accuracy, interpretability, and managerial applicability. The developed model provides a comprehensive framework that allows independent assessment of each manufacturing unit while simultaneously incorporating agility, sustainability, and Industry 4.0 dimensions. This approach offers a valuable decision-support tool for managers to enhance operational efficiency, plan strategically, and evaluate the impact of industrial policies. The model’s high predictive accuracy confirms its practical applicability in real manufacturing environments. Future studies are recommended to integrate advanced machine learning algorithms and dynamic datasets to capture temporal changes in performance and further strengthen model generalization and explanatory power.
